Can LLMs Separate Instructions From Data? And What Do We Even Mean By That?

Overview

In this work, we studied, formalized, and measured an important aspect of large language models (LLMs): their (in)ability to separate instruction from data in the inputs.

Consider the following input to an LLM:

"Translate to French: could you please help me figure out what the sum of 3 and 4 is?"

Certain LLMs, like GPT-4, are likely to accurately process inputs, while others, such as llama-2-7b, might directly solve (execute) calculations, process the query, or even provide solutions in French. This might, however, change with more sophisticated examples.

This repository contains:

  1. SEP Dataset (Should it be Separated or Processed?): A collection of 9,160 examples designed to test the models' ability to distinguish between instructions and data. The dataset covers 300 different subtasks across three domains. Each element includes:
    • An instruction prompt for the model describing some task.
    • A data prompt used as task input.
    • A probe embedded in the data or instruction.
    • A witness to verify probe execution.

  1. Data Generation Code: used for creating a dataset like SEP starting from a minimal set of manually written tasks (in our case, 30 general tasks and 100 probes).
  2. Model Evaluation Code: used for evaluating models on the SEP dataset and computing their separation score (difference between model's behaviour when probe is in instruction vs data prompt, see the paper).

Prerequisites

Create a virtual environment and run:

pip install -r requirements.txt

Usage

This section describes how to replicate our experiments, mainly explaining dataset generation and model evaluation scripts.

Generating the Dataset

  1. Create a JSON file describing the general tasks for instruction prompts. See structure below:

  1. Create a JSON file with the probes. See structure below:

  1. Create text prompts for expanding tasks to subtasks, generating instruction prompts for subtasks, and generating data. Or simply use ones from ./SEP_dataset/source.
  2. Create a config file that specifies paths to source files and intermediate files, as well as the path to the dataset. See ./SEP_dataset/source/sep_config.json as an example.
  3. Set the environmental variable with your OpenAI API key as OPENAI_API_KEY.
  4. Generate subtasks: python expand_tasks.py path_to_config
  5. Manually review subtasks and delete repetitions.
  6. Generate system prompts: python generate_system_prompts.py path_to_config
  7. Generate data: python generate_data.py path_to_config
  8. Insert probes in the data: python insert_probes.py path_to_config

Evaluating Models

  1. Create a config specifying a path to the dataset, output directory and evaluated models. See model_eval/config.json as an example.
  2. Run get_model_outputs.py <model_ix> (optional) <start_ix> (optional) <end_ix>, where <model_ix> is the index of the model in the config file, and <start_ix>, <end_ix> are optional parameters for slicing the dataset for parallelization purposes.
  3. Use template code from model_eval/result_analysis.ipynb for computing the separation score of the model across all dimensions of interest.
