Overview

This repository contains code for generating sense-related bias examples. Specifically, we release two types of datasets for evaluating sense-sensitive word embeddings.

  1. A context-independent dataset, which can be used to evaluate static sense-sensitive word embeddings. We refer to this dataset as Context-Independent Sense-Sensitive Social Bias Evaluation dataset.
  2. A contextual dataset, which can be used to evaluate contextualised sense-sensitive word embeddings. We refer to this dataset as Contextual Sense-Sensitive Social Bias Evaluation dataset.

Context-Independent Sense-Sensitive Social Bias Evaluation Dataset

We define a particular bias type by the average of the vector offsets over attribute word-pairs. For example, in the case of gender bias evaluation, we consider word-pairs such as (he, she), (actor, actress), (waiter, waitress) etc. to represent the gender direction. For racial bias (nationality vs. language) and ethnic bias (ethnicity vs. colour), we use attribute word-pairs pleasant and unpleasant attributes such as (ugly, beautiful), (unkind, kind), (hostile, peaceful) etc. to compute a bias direction. We then compute the bias score as the average cosine similarity between the bias directional vector and the word embedding of the target (ambiguous) word. For all attribute words we consider their dominant sense according to the WordNet. For the target word, we consider each of its senses separately and report the bias scores. Following WEAT, we compute statistical significance by performing a bootstrapping sampling.

We use the following sources to find positive and negative attribute words.

Contextual Sense-Sensitive Social Bias Evaluation

These examples can be used to evaluate social biases in masked language models (MLMs). Several bias evaluation scores have been proposed in prior work that use likelihood-based scoring methods.

This dataset contains the following three bias types.

Nationality vs. Language Bias

This is the bias related to a nationality, which can also denote a language. The two senses are distinct and the following example shows how they can be biased.

Japanese people are nice is a an anti-stereotype for the nationality because it is associated with a pleasant attribute (i.e. nice) in this example.

On the other hand, Japanese people are stupid is a stereotype for the nationality because it is associated with an unpleasant attribute (i.e. stupid) in this example.

For the language sense of Japanese we have similar examples.

Japanese language is difficult to understand is a stereotype for the language because it is associated with an unpleasant attribute (i.e. difficult) in this example.

Japanese language is easy to understand is an anti-stereotype for the language because it is associated with a pleasant attribute (i.e. easy) in this example.

We indicate the sense-type, WordNet sense-id and the bias in each example as follows: Japanese people are beautiful. [nationality, japanese%1:18:00::, anti] Here, sense-type is nationality, sense-id is japanese%1:18:00:: and the bias is anti (anti-stereotype) (for stereotypical biases we use the label stereo). This notation is used throughout the dataset for all bias types described below.

If the likelihood score returned by an MLM for the example that uses an unpleasant attribute is higher than the one that uses a plesant attribute, then we can consider the MLM to be socially biased.

Note: You could drop the modifiers people and language in these examples and consider examples such as Japanese are stupid and Japanese is difficult to understand as additional examples. However, the sense-sensitive embedding methods might find it difficult to automatically disambiguate the correct senses without these modifiers.

Race vs. Colour Bias

The word black can be used to repersent the race (black people) or the colour. We create examples that distinguish these two senses of black as in the following example.

Black people are friendly represents an anti-stereotype towards the race because it is associated with a pleasant attribute (i.e. friendly) whereas, Black people are arrogant represents a stereotype because it is associated with an unpleasant attribute (i.e. arrogant).

On the other hand, for the colour black, The black dress is elegant represents an anti-stereotype because it is associated with a pleasant attribute (i.e. elegant), whereas The black dress is ugly represents a stereotype because it is associated with an unpleasant attribute (i.e. ugly).

If the likelihood score returned by an MLM for the example that uses an unpleasant attribute is higher than the one that uses a pleasant attribute, then we can consider the MLM to be socially biased.

Gender Bias

To create sense-related bias examples for gender (we consider only male and female genders here), we create examples based on occupations. In particular, we consider occupation such as engineer, which can be used in a noun sense (a person who uses scientific knowledge to solve practical problems) or in a verb sense (design something as an engineer). Note that the ambiguity here is in the occupation and not the gender.

Consider the following examples.

She is a talented engineer This is considered as a anti-stereotypical example for the noun sense of engineer because females are not usually associated with pleasant attributes (i.e. talented) with this occupation (i.e. engineer).

He is a talented engineer This is considered as an stereotypical example for the noun sense of engineer because males are usually associated with pleasant attributes with regard to occupations.

If an MLM assigns a higher likelihood to the male version (second example) than the female version (first example), then it is considered to be socially biased.

On the other hand, She is a clumsy engineer is considered as a stereotypical example for the noun sense of engineer because females are usually associated with such unpleasant attributes (i.e. clumsy).

Likewise, He is a clumsy engineer is considered as an anti-stereotypical example for the noun sense of engineer because males are not usually associated with such unpleasant attributes (i.e. clumsy).

If an MLM assigns a higher likelihood to the female version (first example) than the male version (second example), then it is considered to be socially biased. Note that the evaluation direction is reversed here because we are using an unpleasant attribute in the second set of examples.

For the verb sense of engineer, we create examples as follows.

She used novel material to engineer the bridge Here, the word engineer is used in the verb sense in a sentence where the subject is a female.

The male version of this example is: He used novel material to engineer the bridge If an MLM assigns a higher likelihood to the male version than it does to the female version, then it is considered to be socially biased.
