NLI-CoAL Bias Evaluation Dataset

Datasets from the paper: Evaluating Gender Bias of Pre-trained Language Models in Natural Language Inference by Considering All Labels (LREC-COLING'24).

Highlights:

  • We created gender bias evaluation datasets for Pre-trained Language Models (PLM). The task is Natural Language Inference (NLI).
  • We proposed a bias evaluation measurement method called NLI-CoAL, which considering all output labels of NLI task (entailment, neutral, contradiction).
  • We also created datasets that are used for meta-evaluation (evaluation of evaluation) our NLI bias measure.
  • There are datasets available for English, Japanese, and Chinese PLMs 🇺🇸🇯🇵🇨🇳

About the datasets and how to use

There are mainly two sets of data: one for evaluation of models ("Evaluation set"), and one for meta-evaluation of our proposed evaluation measure ("Meta-evaluation set"). We provided both datasets for English, Japanese, and Chinese language.

1. Evaluation set

Below are examples of the data, with "sentence1" and "sentence2" denote premise and hypothesis sentence, respectively.

There are three NLI datasets to use in the evaluation set, Pro-stereotypical (PS), Anti-stereotypical (AS), and Non-stereotypical (NS) set. Assuming we have acquired the stereotypical type of each occupation word:

  • Pro-stereotypical (PS) set: consists of sentence pairs in which the premise sentence contains either a female or male stereotypical occupation word, and the hypothesis sentence contains the gender word corresponding to the stereotype.
  • Anti-stereotypical (AS) set: consists of sentence pairs in which the premise sentence contains either a female or male stereotypical occupation word, and the hypothesis sentence contains the gender word opposite to the stereotype.
  • Non-stereotypical (NS) set: consists of sentence pairs containing a non-stereotypical occupation word and any gender words.

While the correct label is neutral, biased models are expected to predict the examples in the PS and AS set as entailment and contradiction, respectively. For the NS set, we assume that biased models are expected to predict either entailment or contradiction.

How to use

Assuming we have obtained the prediction results in as below:

where each is value is a proportion, i.e. $e_p + c_p + n_p = 1$ and so on.

The bias score can be calculated as: $$\text{bias score} = \frac{e_p + c_a + (1-n_n)}{3}$$

2. Meta-evaluation set

This dataset is for evaluation of our proposed bias evaluation measure. Ones who want to only evaluate their models do not need this dataset.

For details and reasons behind the meta-evaluation, please refer to the paper.

How to use

  1. Train an NLI model (fine-tuned PLM) with a train set in bias-controlled-set one at a time, repeatedly with 11 train sets. Their differences are the proportion of biased examples (bias rate: $r$) within the train set.
  2. Evaluate all the 11 fine-tuned models with the evaluation set (1.) using the downsampled version.
  3. Observe the rank correlation between the obtained bias scores along with bias rate $r$. High correlation is expected for an accurate bias measure.

Remarks

Downsampled datasets are for meta-evaluation. The number of occupation words is downsampled corresponding to the train set in meta-evaluation for label-balancing purpose.

    abstract = "Discriminatory gender biases have been found in Pre-trained Language Models (PLMs) for multiple languages. In Natural Language Inference (NLI), existing bias evaluation methods have focused on the prediction results of one specific label out of three labels, such as neutral. However, such evaluation methods can be inaccurate since unique biased inferences are associated with unique prediction labels. Addressing this limitation, we propose a bias evaluation method for PLMs, called NLI-CoAL, which considers all the three labels of NLI task. First, we create three evaluation data groups that represent different types of biases. Then, we define a bias measure based on the corresponding label output of each data group. In the experiments, we introduce a meta-evaluation technique for NLI bias measures and use it to confirm that our bias measure can distinguish biased, incorrect inferences from non-biased incorrect inferences better than the baseline, resulting in a more accurate bias evaluation. We create the datasets in English, Japanese, and Chinese, and successfully validate the compatibility of our bias measure across multiple languages. Lastly, we observe the bias tendencies in PLMs of different languages. To our knowledge, we are the first to construct evaluation datasets and measure PLMs{'} bias from NLI in Japanese and Chinese.",
