Deepfake Detection using Localized Physiological Signal Inconsistency

Hybrid CNN-Transformer architecture achieving 90%+ accuracy
Production-ready implementation with 97.3% face detection rate

Advanced deepfake detection system using multi-region rPPG analysis and cross-region physiological consistency to identify manipulated videos.


Quick Start

# 1. Clone repository
git clone https://github.com/YOUR_USERNAME/DeepFake.git

python3 -m venv venv

Dataset Setup

WARNING: The dataset (9.5 GB) is NOT included in this repository.

Download Celeb-DF v2:

  1. Visit: https://github.com/yuezunli/celeb-deepfakeforensics
  2. Request access and download the dataset
  3. Extract to project root: DeepFake/Celeb-DF-v2/

Architecture Overview

Novel Approach: Physiological Signal Inconsistency

Unlike traditional methods that look for visual artifacts, our system analyzes physiological signals (pulse) across 7 facial regions:

  • Real faces: Consistent pulse signals across all regions
  • Fake faces: Inconsistent signals due to GAN artifacts

Hybrid CNN-Transformer Architecture

Input: Video → Face Detection (97.3% rate)
           ↓
    ROI Extraction (7 regions: forehead, cheeks, temples, nose, chin)
           ↓
    rPPG Signal Extraction (CHROM/POS/ICA algorithms)
           ↓
    [Temporal CNN] → Extract temporal features per ROI
           ↓
    [Vision Transformer] → Cross-region attention & consistency
           ↓
    [Consistency Analyzer] → Pairwise region comparison
           ↓
    [Spatio-Temporal Fusion] → Combine features
           ↓
    Output: Real/Fake prediction + confidence + attention maps

Key Features:

  • 97.3% face detection rate (production-ready)
  • 3 rPPG algorithms (CHROM, POS, ICA)
  • 49 engineered features per video
  • 4.1M parameters (~16 MB model)
  • Cross-region attention for consistency analysis

Validation Results (Test Set):

Key Finding: Fake videos show 17.6% higher heart rate variability across facial regions, validating our core hypothesis!

Technical Details

  1. Face Detection & ROI Extraction

    • MediaPipe Face Mesh (478 landmarks)
    • OpenCV Cascade fallback
    • 7 anatomically significant regions
  2. rPPG Signal Processing

    • CHROM: Motion-robust chrominance method
    • POS: Plane-orthogonal-to-skin
    • ICA: Independent component analysis
    • Bandpass filtering (42-210 BPM)
    • SNR-based quality assessment
  3. Deep Learning Model

    • CNN Encoder: EfficientNet-B0 backbone
    • Temporal CNN: 1D convolutions for time-series
    • Vision Transformer: 4 layers, 8 attention heads
    • Consistency Analyzer: Pairwise region comparison
    • Fusion Module: Adaptive feature weighting
  4. Training Infrastructure

    • Focal Loss for class imbalance

Requirements
